چکیده

مقدمه
پیش‌بینی دقیق رواناب نقش اساسی در مدیریت منابع آب، کنترل سیلاب و برنامه‌ریزی سازگاری با تغییر اقلیم دارد. با توجه به ماهیت غیرخطی، پیچیده و چندعاملی فرایندهای هیدرولوژیک، استفاده از روش‌های داده‌محور و الگوریتم‌های یادگیری ماشین در سال‌های اخیر به رویکردی کارآمد برای تحلیل و مدلسازی رواناب تبدیل شده است. دو مدل انفرادی XGBoost، CatBoost و مدل هیبریدی Boost(Cat-XG) به‌منظور پیش‌بینیِ روانابِ حوزه آبخیز کرج مورد ارزیابی قرار گرفتند. مطالعات اندکی به مقایسه‌ این دو الگوریتم و ارائه یک ترکیب هیبریدیِ هوشمند در سطح ماهانه پرداخته‌اند. پژوهش حاضر ضمن پر کردن این شکاف پژوهشی می‌تواند راهنمایی عملی برای برنامه‌ریزان منابع آب و سامانه‌های هشدارِ مدیریت منابع در شرایط تغییر اقلیم فراهم کند.
 
مواد و روش‌­ها
در پژوهش حاضر، کارایی دو مدل پرکاربرد  انفرادیِ یادگیری عمیق شامل CatBoost، XGBoost و یک مدل هیبریدیِ نوین تحت عنوان (Cat-XG)Boost در پیش‌بینی رواناب ماهانه حوزه‌آبخیز کرج ارزیابی شد. برای این منظور، داده‌های دبی متوسط ماهانه پنج ایستگاه هیدرومتری گچسر، سیرا-کلوان، سیرا-کرج، نشتارود و پل خواب دورود به‌ترتیب میانگین دبی بیشینه ماهانه 17.22، 16.56، 12.11، 0.36 و 0.28 در حوزه آبخیز کرج طی دوره آماری بلندمدت 30 ساله (1371-1400) به‌عنوان ورودی مدل‌ها مورد استفاده قرار گرفت. را به ثبت رساندند. پس از انجام فرایندهای پیش‌پردازش، نرمال‌سازی، حذف داده‌های پرت، بررسی ایستایی و تبدیل ورودی‌ها به‌عنوان ورودی، مدل‌ها مورد استفاده قرار گرفت. مدل‌ها با 4 معیار ارزیابی NS، R، RMSE و MAE سنجیده شدند. پیش‌بینی‌های مدل‌های مورد پژوهش در چهار حالت به ثبت رسید. حالت نخست، دبی متوسط سه ماه گذشته به‌عنوان ورودی مدل در نظر گرفته شد. در سناریوی دوم، دبی متوسط شش ماه قبل وارد مدل شد. سناریوی سوم با استفاده از سه فصل تأخیر متوالی (نه ماه) دبی متوسط ماهانه طراحی شد. سناریوی چهارم شامل یک سال وقفه زمانی متوالی بوده است.
 
نتایج و بحث
نتایج پیش‌بینی‌ها نشان داد که مدل هیبریدی (Cat-XG)Boost با اختلاف قابل‌توجهی بهترین عملکرد را در پیش‌بینی رواناب ماهانه حوزه آبخیز کرج نسبت به دو مدل انفرادی مورد ارزیابی ارائه می‌دهد. این مدل در تمامی ایستگاه‌های مورد بررسی NS بالای 0.957، همبستگی بالای 0.939 به ثبت رساند. همچنین این مدل با اختلاف بسیار، خطاهای کمتری نسبت به دو مدل دیگر ثبت کرد. مقدار RMSE به‌ثبت رسیده برای این مدل در ایستگاه‌های با مقدار داده‌های فراوان‌تر نسبت به سایر ایستگاه‌ها، بیشتر بوده و بین اعداد 1.057 و 1.517 قرار دارد. مقدار خطاهای ثبت شده به نسبت دو مدل دیگر که خطاهای بالای پنج را ثبت نمودند، عملکرد مثبت مدل هیبریدی پیشنهادی را نشان می‌دهد. اما در ایستگاه‌های با داده‌های کمتر، مقادیر کمی از خطا و در محدوده‌های 0.027 تا 0.037 برآورد شده است. همچنین مقادیر MAE ثبت شده برای مدل هیبریدی پیشنهادی نشان می‌دهد که مقادیر به‌دست آمده مشابه مقادیر محاسبه شده برای RMSE، بین محدوده 0.09 برای ایستگاه‌های با مقدار داده‌های ثبت شده کمتر و 1.454 برای ایستگاه‌های با مقدار داده ثبت شده بیشتر محاسبه شده است. درحالی‌که مدل‌هایِ انفرادیِ XGBoost و CatBoost به‌ویژه در ایستگاه‌های با داده‌های گسترده‌تر با افزایش خطا به مقدار بالای هفت مواجه شدند. تحلیل نمودارهای همبستگی نیز نشان داد که مدل تلفیقی بیش‌ترین انطباق را با مقادیر واقعی داشته و الگوهای پیچیده رواناب را با دقت بالاتری مورد شناسایی قرار داده است. نتایج به‌دست آمده از پژوهش حاضر با مطالعات بین‌المللی نیز همخوانی داشت. دو مدل انفرادی مورد پژوهش عملکرد متوسط در پیش‌بینی مقادیر مرتبط با وقایع حدی اقلیمی ارائه کردند اما با ترکیب دو مدل انفرادی و معرفی مدل هیبریدی Boost(Cat-XG)، عیوب موجود در مدل‌های انفرادی پوشیده شده و همچنین با رفع خطاهای موجود، پیش‌بینی‌های بسیار دقیق‌تری به ثبت رسید.
 
نتیجه‌­گیری
نتایج پژوهش حاضر بیان‌گر آن است که مدل هیبریدی (Cat-XG)Boost می‌تواند به‌عنوان ابزاری قدرتمند برای پیش‌بینیِ رواناب در حوضه‌های کوهستانی و حساس به تغییر اقلیم به‌کار گرفته شود و به‌منظور توسعه سامانه‌هایِ هشدارِ سریع، مدیریت مخازن و برنامه‌ریزیِ راهبردیِ منابع آب نقش مؤثری ایفاء کند. نتایج به‌دست آمده نشان داد که مدل هیبریدیِ پیشنهادی، بهترین خروجی‌ها را به‌ثبت رساند. در تمامی ایستگاه‌های مورد مطالعه، مقدار NS بالای 0.951 و همبستگی بالای 0.939 ثبت شد. همچنین، این مدل به‌طور محسوسی، مقادیر خطای MAE و RMSE را کاهش داد. در سه ایستگاه گچسر، سیرا-کلون و سیرا کرج که بیشترین مقادیر داده‌ای را دارا بودند، خطای بیشتری به نسبت سه ایستگاه دیگر به‌ثبت رسید. خطای ثبت شده بالاتر سه ایستگاه ذکر شده به‌دلیل میزان بالاتر نوسانات دبی بیشینه ماهانه این ایستگاه‌ها بوده که باعث ثبت خطاها در اعداد بزرگ‌تر شده است. یافته‌های پژوهش حاضر تأیید می‌کند که رویکردهای ترکیبی در مواجهه با داده‌های پیچیده هیدرولوژیک، مزیت قابل‌توجهی نسبت به مدل‌های انفرادی دارند. از این مدل می‌توان به‌عنوان ابزاری سودمند در مطالعات مدیریت منابع آب، پیش‌بینی خشکسالی و سیلاب‌های فصلی و ارائه سناریوهای تصمیم‌گیری در سطوح حوضه‌ای مورد استفاده نمود.

Introduction
Accurate runoff prediction plays a crucial role in water resource management, flood control and climate change adaptation planning. Given the nonlinear, complex and multifactorial nature of hydrological processes, the use of data-driven methods and machine learning algorithms has become an efficient approach for runoff analysis and modeling in recent years. Two individual models, XGBoost, CatBoost and a hybrid model of this two single models, (Cat-XG)Boost were evaluated to predict runoff in the Karaj watershed. Few studies have compared these two algorithms and presented an intelligent hybrid combination at the monthly level.While filling this research gap the present study can provide practical guidance for water resource planners and resource management warning systems in climate change conditions.
 
Materials and method
In the present study, the efficiency of two widely used individual deep learning models, including CatBoost, XGBoost and a novel hybrid model called (Cat-XG)Boost were evaluated in predicting monthly runoff in the Karaj watershed. For this purpose, monthly average discharge data from five hydrometric stations of Gachsara, Sira-Kaloan, Sira-Karaj, Neshtarud and Pol-e-Khab Dorud with maximum monthly average discharge of 17.22, 16.56, 12.11, 0.36 and 0.28, respectively, in the Karaj watershed during the long-term statistical period of 30 years (1371-1400) were used as model inputs. After performing preprocessing, normalization, outlier removal, stationarity check and input transformation processes, the models were used as inputs. The models were measured with 4 evaluation criteria NS, R, RMSE and MAE. The predictions of the studied models were recorded in 4 states. First, the average discharge of the past 3 months was considered as the model input. In the second scenario, the average discharge of the 6 months before was entered into the model. The third scenario was designed using three consecutive delay seasons (9 months) of monthly average discharge. The fourth scenario included a year of consecutive time lag.
 
Results and discussion
The prediction results showed that the hybrid model (Cat-XG)Boost with a significant difference provides the best performance in predicting monthly runoff of the Karaj watershed compared to the two individual models evaluated. This model recorded NS above 0.957 and correlation above 0.939 in all stations studied. In addition, it recorded significantly fewer errors than the other two models. While the individual models XGBoost and CatBoost, especially in stations with more extensive data, faced increased errors. Analysis of correlation diagrams also showed that the integrated model had the highest agreement with the actual values and identified complex runoff patterns with higher accuracy. The results obtained from the present study were also consistent with international studies. The two individual models studied provided average performance in predicting values related to extreme climate events but by combining the two individual models and introducing the hybrid model Boost(Cat-XG), the defects in the individual models were covered and also by eliminating existing errors, much more accurate predictions were recorded.
 
 
 
Conclusion
The results of the present study indicate that the hybrid model (Cat-XG)Boost can be used as a powerful tool for runoff prediction in mountainous and climate change-sensitive basins and play an effective role in the development of rapid warning systems, reservoir management and strategic water resource planning. The findings of the present study confirm that combined approaches in the face of complex hydrological data have a significant advantage over single models. This model can be used as a useful tool in water resource management studies, prediction of drought and seasonal floods and presentation of decision-making scenarios at the basin level.
